Abstract

The article presents and scientifically substantiates a multimodal neural network model for high-precision short-term forecasting of solar power generation in residential systems. Unlike traditional unimodal approaches, the proposed model comprehensively integrates three heterogeneous data streams: numerical weather predictions (NWP), high-resolution satellite imagery of cloud cover, and physical parameters of the photovoltaic (PV) system. The research addresses the critical challenge of high generation uncertainty in renewable energy, which directly impacts the stability of local microgrids and the efficiency of home energy management systems (HEMS) in a dynamic energy market. The paper describes a complex hybrid architecture combining a convolutional module (CNN) for deep spatial analysis of cloud dynamics on satellite images and a long short-term memory (LSTM) module for identifying temporal dependencies in meteorological time series. Convolutional layers effectively extract features of cloud texture, density, and motion vectors, which are crucial for predicting sudden drops in solar irradiance. A key innovation is the feature fusion block with a cross-modal attention mechanism. This component allows the neural network to dynamically adapt the weights of each modality (visual, numerical, and physical) based on the current weather context, time of day, and atmospheric transparency. The scientific novelty lies in the development of an adaptive incremental learning algorithm for continuous model fine-tuning to specific local conditions of a household, such as microclimate, panel orientation, and local shading. The advantages of the multimodal approach are substantiated through a rigorous comparative analysis using MAE, RMSE, MBE, and rRMSE metrics. Experiments demonstrate that real-time satellite imagery integration reduces forecasting errors under variable cloudiness by 18–22% compared to ground-based models. The results enable advanced predictive energy management within the household’s digital twin, optimizing battery storage strategies and maximizing energy independence within the Smart Grid framework.
