This work proposes Adaptive Parameter Manifold Learning (APML), a novel optimization framework that leverages Local Tangent Space Alignment to discover the underlying manifold structure from training trajectories and optimize neural networks on the parameter manifolds.
Abstract
Deep neural networks have achieved remarkable success across diverse domains, yet their massive over-parameterization introduces significant optimization challenges, particularly susceptibility to overfitting and noise memorization. While traditional stochastic gradient descent treats all parameters equally in the native parameter space, recent evidence suggests that neural network optimization occurs within much lower-dimensional subspaces. Existing parameter subspace methods either rely on random projections that ignore parameter space structure or employ linear dimensionality reduction that cannot capture complex geometric relationships. Through empirical analysis of training trajectories, we demonstrate that neural network parameters evolve along continuous, low-dimensional non-linear manifolds whose intrinsic dimensionality is substantially lower than the original parameter space. We propose Adaptive Parameter Manifold Learning (APML), a novel optimization framework that leverages Local Tangent Space Alignment to discover the underlying manifold structure from training trajectories and optimize neural networks on the parameter manifolds. Our method dynamically adapts the manifold throughout training to accommodate the changing geometry of the loss landscape. Extensive experiments on noisy label learning tasks across vision and language domains, as well as federated learning scenarios, demonstrate that APML achieves superior robustness and communication efficiency compared to existing subspace optimization methods.
Deep neural networks demonstrate remarkable generalization despite being highly over-parameterized, challenging traditional statistical learning theories. While several theoretical paradigms such as margin-based bounds, PAC-Bayesian analyses, and neural tangent kernels provide global explanations, they often lack mecha...

Generative models are often trained with isotropic objectives such as mean-squared error. For data concentrated near a low-dimensional manifold, however, such losses conflate displacement along the manifold, which may represent valid variation, with displacement away from it, which produces invalid samples. This mismat...

Recently, deep neural networks on manifold-valued representations have garnered significant attention across various machine learning applications. One recent focus is the generalization of Euclidean fully connected (FC) and convolutional layers to non-Euclidean geometries. However, previous approaches typically focus...
Riemannian manifolds are powerful models for problems with non-Euclidean structure. Recent work in geometric machine learning has focused on training deep neural networks to learn Riemannian metrics from high-dimensional data. However, many geometric algorithms require repeated evaluations of the exponential and logari...
On a single task, deep neural networks can learn a wide range of solutions, depending on their optimizer, training data, architecture, and hyperparameters. Many of these solutions are surprisingly mode-connected: rather than isolated points in the weight space, they are connected by low loss regions. Despite this obser...
