Abstract

Timely and accurate defect classification is critical for ensuring product quality and safety in industrial inspection scenarios. The widespread deployment of Internet of Things (IoT) devices equipped with sensing, computing, and communication capabilities has promoted the development of AI-enabled industrial applications. However, conventional AI approaches typically rely on centralized data collection and processing, which become impractical in real-world IoT environments due to growing privacy concerns and constrained device resources. To address these challenges, this paper proposes a communication-efficient adaptive federated learning algorithm for heterogeneous defect classification tasks. The proposed approach jointly accelerates the training process through three mechanisms: (i) adaptive local updates that balance communication and computation overheads; (ii) parameter compression that trades off communication cost against model accuracy; (iii) joint bandwidth and computation-power allocation that optimizes per-round communication and computation time across participating devices. We further analyze the joint effects of these three mechanisms and provide a convergence analysis. Extensive simulations show that the proposed method achieves competitive classification accuracy while reducing single-round training time by up to 70%.

Dynamic Weighting and Adaptive Sparse Transformer for Federated Fault Diagnosis

With the rapid development of the Internet of Things (IoT) and edge computing, the scale and complexity of modern networks have increased significantly, driving the demand for distributed fault diagnosis. Federated learning (FL) effectively addresses the issues of data privacy and dispersion by enabling edge devices to collaboratively train models without sharing raw data. However, existing FL-based fault diagnosis methods still encounter the following challenges. Firstly, static aggregation strategies struggle to balance the contributions of heterogeneous clients dynamically. Secondly, traditional local models are unable to effectively decouple sparse high and low-frequency features in fault signals, thereby limiting the accuracy of fault identification. Finally, the resource constraints of edge devices restrict the deployment of complex diagnostic models. To address these challenges, we propose a federated learning hybrid dynamic weight adjustment method based on delay and model quality, introducing the concept of “accelerated depreciation” in accounting and taxation and the concept of “asset allocation” in economics to improve the communication efficiency of fault diagnosis and reduce the impact of delay differences due to device heterogeneity on the effect of fault diagnosis. Additionally, we propose an adaptive sparse low high frequencies Transformer, introducing a lightweight attention mechanism and an adaptive feature extraction layer, which significantly reduces the computational overhead while maintaining high diagnostic accuracy. The experimental results show that, compared with the most competitive baseline, our method improves the fault diagnosis accuracy by 1% on the Case Western Reserve University Bearing dataset (CWRU), 0.78% on the Xi’an Jiaotong University Gearbox dataset (XJTU), and 0.44% on the Micro service Edge Computing dataset (MICRO).

Constrained Bayesian Optimization for Hierarchical Federated Learning in IoT Networks for Plant Disease Classification

The deployment of Hierarchical Federated Learning (HFL) in resource-constrained Internet of Things (IoT) environments requires careful configuration to balance predictive performance with energy consumption and execution time. This challenge is particularly relevant to smart agriculture, where distributed IoT devices can support automated plant disease classification while operating under limited computational and communication resources. This paper presents a constrained Bayesian Optimization framework for the efficient configuration of HFL deployments. The proposed approach jointly explores the deep learning backbone architecture, aggregation strategy, and number of communication rounds, while the federation size is determined according to the spatial coverage requirements of the agricultural deployment. A weighted objective function captures user-defined trade-offs among energy consumption, execution time, and predictive performance, while explicit constraints ensure compliance with deployment-specific resource and accuracy requirements. The framework is evaluated on an IoT-based plant disease classification task considering multiple deep learning architectures, federated aggregation strategies, and communication-round settings. Experimental results across 30 independent optimization runs show that the proposed approach explores only 11.11% of the search space, while consistently identifying solutions within 1% of the exhaustive-search optimum, with a mean optimality gap of only 0.056%.

LBSFL: a lightweight robust federated learning method for IoT
